Why Fine-Tune?
Generic LLMs like GPT-4 and Claude are incredibly capable. But they have three critical limitations for enterprise use:
-
They don't know your business. They can't answer questions about your proprietary processes, terminology, or data.
-
They hallucinate on domain-specific queries. Ask GPT-4 about your internal product SKUs and watch it confidently make things up.
-
Your data leaves your control. Every API call sends your proprietary information to a third party.
Fine-tuning solves all three.
The 30-Day Protocol
This is the exact process we use with our LLM Foundry Pod clients. It's been refined across dozens of engagements.
Phase 1: The Audit (Days 1-7)
Goal: Define the use case and establish the secure data perimeter.
Day 1-2: Discovery Workshop
We sit with your stakeholders to answer one question: What do you want this model to do?
Bad answer: "We want AI." Good answer: "We want a chatbot that answers support queries based on our 500 PDF technical manuals with <5% hallucination rate."
The more specific, the better. We'll help you get there.
Day 3-4: Model Selection
Based on your requirements, we select:
- Base model: Llama 3, Mistral, or others based on your licensing needs
- Technique: Fine-tuning vs. RAG vs. hybrid
- Infrastructure: Cloud provider, GPU requirements, cost projections
Day 5-7: Infrastructure Setup
We spin up a secure, air-gapped VPC on your preferred cloud provider. This includes:
- Private subnet with no internet egress
- VDI (Virtual Desktop Infrastructure) for data curators
- Encrypted storage with your KMS keys
- Audit logging for compliance
Deliverable: Architecture document & secure "Data Vault" access.
Phase 2: The Curation Grind (Days 8-21)
Goal: Turn messy documents into high-quality training data.
This is the hardest part. It's also where most internal AI projects fail. Data quality determines model quality.
The Data Ingestion Pipeline
You dump raw files into the Data Vault:
- PDFs (technical manuals, SOPs)
- CSVs (structured data, logs)
- Slack/Email exports (conversational data)
- JSON (API responses, configs)
Automated Cleaning
Our engineering team runs extraction and cleaning:
- PII removal (names, emails, SSNs)
- Duplicate detection and removal
- Format standardization
- Metadata extraction
Human-in-the-Loop Curation
This is where our India-based data team earns their keep:
- Sample Review: Humans review random samples for quality
- Q&A Pair Generation: For every document, we generate question-answer pairs
- Relevance Tagging: Is this data actually useful for your use case?
- Edge Case Identification: What queries will break the model?
We typically process 10,000-50,000 rows per engagement. Each row gets human eyes.
Deliverable: A "Golden Dataset" in .jsonl format, ready for training.
Phase 3: Fine-Tuning & Evaluation (Days 22-28)
Goal: Teach the model your domain.
Training Runs
We use QLoRA (Quantized Low-Rank Adaptation) for efficient fine-tuning:
Model: Llama-3-70B
Technique: QLoRA (4-bit quantization)
Hardware: 4x A100 80GB
Training time: ~8 hours
We typically run 3-5 training iterations, adjusting hyperparameters based on loss curves.
The Arena Evaluation
Here's where it gets interesting. We deploy your fine-tuned model alongside a generic GPT-4 baseline.
We run 100+ real-world queries from your business through both models. Human experts (your team) do blind evaluation—they don't know which response came from which model.
We measure:
- Accuracy: Did the model give the correct answer?
- Hallucination rate: Did it make things up?
- Tone matching: Does it sound like your brand?
- Latency: How fast is the response?
Deliverable: Evaluation report with head-to-head comparison.
Phase 4: Deployment & Handoff (Day 30)
Goal: Get the model into production and transfer ownership.
Production Deployment
We wrap the model in a production-ready API:
- FastAPI or similar framework
- Authentication and rate limiting
- Monitoring and logging
- Auto-scaling configuration
IP Transfer
The legal part. You receive:
- Full model weights (.safetensors file)
- The Golden Dataset
- All training scripts and configs
- Documentation for retraining
You own everything. No ongoing licensing fees. No API costs. Your model, your data, your infrastructure.
Cost Comparison
Let's compare the TCO of fine-tuning vs. API usage:
| Scenario | GPT-4 API | Fine-Tuned Model | |----------|-----------|------------------| | 100k queries/month | $15,000/month | $3,000/month (inference) | | Data privacy | Data sent to OpenAI | Data never leaves your VPC | | Customization | None | Fully customized | | Ownership | None | Full IP ownership |
For high-volume use cases, fine-tuning pays for itself in 3-6 months.
When NOT to Fine-Tune
To be clear, fine-tuning isn't always the answer:
- Low query volume: If you're doing <1000 queries/month, API costs are negligible
- Generic use cases: If GPT-4 already handles your queries well, don't fix what isn't broken
- No proprietary data: If you don't have domain-specific data to train on, fine-tuning won't help
- Rapidly changing information: Fine-tuned knowledge is frozen; use RAG for dynamic data
Getting Started
The first step is a Discovery Workshop. We'll assess your use case, data assets, and requirements. From there, we'll tell you honestly whether fine-tuning makes sense—or if there's a simpler solution.
